πŸ€– APEX Data Pipeline Engineer – RL Environment

OpenEnv-Compliant | Production-Ready | Real-World Data Engineering Tasks

What is APEX?

APEX is a reinforcement learning environment for training autonomous agents to handle real-world data engineering workflows. Instead of toy coding problems, APEX models actual challenges engineers face:

  • β€”Writing ETL pipelines from messy CSV/JSON data
  • β€”Debugging broken transformations with cascading errors
  • β€”Reviewing production code for subtle data quality bugs
  • β€”Iteratively fixing issues with hidden test cases

Domain: pandas, SQL-like operations, data validation, error recovery.

Task Design: 3 Modes Γ— 3 Difficulties = 18 Real Tasks

πŸ’» SOLVE Mode: Write Data Pipelines from Scratch

Agent gets raw data + requirements. Must write correct pandas code in ≀5 steps.

Real-world examples:

  • β€”Aggregate sales by customer from transaction logs
  • β€”Flatten nested JSON customer records
  • β€”Detect duplicate transactions in banking data
  • β€”Multi-source merge with fuzzy matching

Rewards: Visible tests (40%) + hidden tests (60%) - efficiency bonus for solving fast

πŸ” REVIEW Mode: Identify & Fix Data Pipeline Bugs

Agent reviews code with intentional bugs. Must pinpoint bug type, location, and fix.

Real-world bugs:

  • β€”Wrong aggregation column (groups by product instead of customer)
  • β€”Missing null handling (crashes on NaN values)
  • β€”Incorrect merge type (cartesian product instead of inner)
  • β€”Timezone conversion errors in time-series data

Rewards: Location (25%) + bug type (20%) + explanation (20%) + fixed code (35%)

πŸ› DEBUG Mode: Fix Cascading Errors

Code crashes. Each agent step reveals the next hidden error. Must recover iteratively.

Real-world examples:

  • β€”Step 1: KeyError on 'unit_price' β†’ Must rename column
  • β€”Step 2: TypeError on date arithmetic β†’ Must convert to datetime
  • β€”Step 3: Logic bug in groupby β†’ Must rewrite aggregation

Rewards: Tests passed + cascading bonus if all errors fixed in hard tasks

Performance & Challenge Level

DifficultySolveReviewDebugInterpretation
EASY0.70–0.850.65–0.800.75–0.90Achievable for baseline agents
MEDIUM0.50–0.650.45–0.600.50–0.65Significant drop; requires semantic understanding
HARD0.30–0.500.25–0.450.30–0.50Agents struggle here β€” real challenge

Key insight: Baseline (Qwen 72B) achieves high scores on easy tasks but struggles with hard multi-step scenarios, showing genuine difficulty progression.

OpenEnv API (Standardized Interface)

APEX implements the OpenEnv v1 specification for standardized agent-environment interaction:

`POST /reset(task_type, difficulty)`

Initializes a new episode with a random task.

python
response = {
    "session_id": "uuid",
    "observation": {
        "task_id": "medium-solve-001",
        "title": "Duplicate Transaction Detector",
        "description": "...",
        "data_sample": {"format": "csv", "content": "..."},
        "function_signature": "def detect_duplicates(df):",
        "visible_test_results": [...],
        "passed_cases": 0,
        "total_cases": 5
    }
}

`POST /step(code, session_id)`

Executes agent's code and returns reward + next state.

python
response = {
    "observation": {...},  # Updated state
    "reward": 0.65,         # [0.0, 1.0] clipped
    "done": false,          # Episode complete?
    "info": {
        "passed_cases": 3,
        "total_cases": 5,
        "error_message": null
    }
}

`GET /state(session_id)`

Retrieves current session state (for resuming/monitoring).

python
{
    "session_id": "uuid",
    "task_id": "medium-solve-001",
    "step_count": 2,
    "max_steps": 5,
    "best_reward": 0.65,
    "episode_history": [0.3, 0.65]
}

Environment Features

βœ… 18 Deterministic Tasks – No randomness in grading; programmatic assertions only βœ… Partial Credit – Intermediate progress rewarded (visible + hidden test split) βœ… Sandboxed Execution – Safe pandas code runs with 10s timeout + memory limits βœ… Multi-Session Support – Parallel agents with isolated state via UUIDs βœ… Real Data Samples – Actual CSV/JSON/log formats in observations βœ… Structured Rewards – Task-specific reward functions (solve/review/debug modes) βœ… Auto-Discovery – /manifest endpoint describes all capabilities

How to Use

Option 1: Interactive Gradio UI (Easiest)

bash
python app_gradio.py

Visit the Gradio interface to manually test tasks interactively.

Option 2: REST API (Programmatic)

bash
python run_server.py
# Server starts at http://localhost:7860

Example agent code:

python
import requests

# 1. Reset environment
resp = requests.post("http://localhost:7860/reset",
                     json={"task_type": "solve", "difficulty": "easy"})
session_id = resp.json()["session_id"]
observation = resp.json()["observation"]

# 2. Submit code
code = """
import pandas as pd
def aggregate_sales(df):
    return df.groupby('customer_id')['amount'].sum()
"""

resp = requests.post("http://localhost:7860/step",
                     json={"code": code, "session_id": session_id})
reward = resp.json()["reward"]
done = resp.json()["done"]

Option 3: Run Agent Benchmark (All 18 Tasks)

bash
python inference.py

Runs 18-episode benchmark (6 easy + 6 medium + 6 hard, distributed across solve/review/debug).

Training Autonomous Agents

APEX is purpose-built for training agents to autonomously handle data engineering tasks:

  1. 1.Progressive Complexity: Curriculum learning from easy β†’ medium β†’ hard
  2. 2.Iterative Problem-Solving: Multi-step episodes with feedback (solve code bugs iteratively)
  3. 3.Real-World Scenarios: Not toy problemsβ€”actual data engineering challenges
  4. 4.Error Recovery: Debug mode teaches agents to diagnose and fix cascading failures
  5. 5.Code Generation: Train code-generating models (GPT-4, Llama, etc.) to write production pipelines

Expected agent capabilities after training:

  • β€”Understand data schemas and transformations
  • β€”Debug errors through iterative refinement
  • β€”Handle edge cases (nulls, type mismatches, merges)
  • β€”Optimize for speed + correctness tradeoffs
